Real-Time Anomaly Detection in Modern FinTech
Financial fraud methods evolve rapidly, making static rule-based systems (e.g., “flag transactions over $5,000”) obsolete. Sophisticated fraudsters execute distributed velocity attacks, card testing, and device spoofing that evade simple thresholds. By combining n8n event orchestration with an unsupervised Isolation Forest machine learning model, FinTech engineering teams detect subtle transaction anomalies in real time with sub-second decision latency.
Architected and written by Saizul Amin for FinTech security and automated workflow engineering.
The Detection Architecture: Webhook to Machine Learning Inference
The fraud detection engine follows a decoupled, event-driven pattern:
- Ingestion: Stripe or Core Banking API sends a transaction webhook to an n8n webhook listener.
- Feature Extraction: n8n enriches transaction data with user historical behavior (velocity past 24 hours, geo-distance from last transaction, device fingerprint).
- Inference: n8n dispatches vectorized transaction features to a micro-service running an Isolation Forest anomaly detection model.
- Action Routing: If the anomaly score exceeds the risk threshold, n8n freezes the card, triggers an SMS challenge, and alerts the fraud investigation squad via Slack.
The Machine Learning Engine: Python Isolation Forest
Below is a production FastAPI microservice executing unsupervised anomaly scoring:
from fastapi import FastAPI, HTTPException
from pydantic import BaseModel
import numpy as np
import joblib
app = FastAPI(title="Fraud Anomaly Detection Service")
# Load pre-trained Isolation Forest model and standard scaler
model = joblib.load("models/isolation_forest_fraud.pkl")
scaler = joblib.load("models/feature_scaler.pkl")
class TransactionPayload(BaseModel):
transaction_id: str
user_id: str
amount_usd: float
hourly_velocity: int
distance_from_home_km: float
device_risk_score: float
class AnomalyResponse(BaseModel):
transaction_id: str
is_anomaly: bool
risk_score: float
@app.post("/api/v1/score", response_model=AnomalyResponse)
async def score_transaction(payload: TransactionPayload):
try:
# Vectorize features
features = np.array([[
payload.amount_usd,
payload.hourly_velocity,
payload.distance_from_home_km,
payload.device_risk_score
]])
# Standardize features
scaled_features = scaler.transform(features)
# Anomaly scoring: negative values indicate outliers
score = model.decision_function(scaled_features)[0]
prediction = model.predict(scaled_features)[0] # -1 for anomaly, 1 for normal
# Normalize score into a 0.0 - 1.0 risk index
risk_score = round(float(1.0 - (score + 0.5)), 4)
risk_score = max(0.0, min(1.0, risk_score))
return AnomalyResponse(
transaction_id=payload.transaction_id,
is_anomaly=(prediction == -1 or risk_score > 0.75),
risk_score=risk_score
)
except Exception as e:
raise HTTPException(status_code=500, detail=str(e))
n8n Automation Flow Implementation
In n8n, configure the multi-step automated response pipeline:
- Webhook Trigger Node: Configured for POST
/webhook/transactionsfrom the payment gateway. - HTTP Request Node: Passes the enriched transaction payload to the Python ML microservice (
POST http://ml-service:8000/api/v1/score). - IF Switch Node: Evaluates
{{ $json.is_anomaly === true }}.- TRUE Branch: Calls Stripe API to block charge, issues an automated Slack alert with risk score metrics, and sends a push authentication request to the cardholder.
- FALSE Branch: Logs transaction metadata to ClickHouse data lake for continuous model retraining.
Model Monitoring and Drift Management
Unsupervised models suffer from data drift during major shopping holidays (e.g., Black Friday). Schedule weekly n8n cron workflows to retrain the Isolation Forest model on sliding 30-day windows to prevent elevated false positive rates.
